      <title>From Prototype to Production: Building a Reliable RAG API with FastAPI + ChromaDB</title>

      <description>&lt;p&gt;I recently upgraded my Retrieval-Augmented Generation (RAG) project from a simple demo into a production-grade API.&lt;br&gt;
This post shares the architecture, what I implemented, and the practical lessons I learned.&lt;/p&gt;

  Why I moved beyond a prototype
&lt;/h2&gt;

&lt;p&gt;A prototype can answer questions from documents.&lt;br&gt;
A production system must also be:&lt;/p&gt;

&lt;ul&gt;
&lt;li&gt;reliable under repeated usage,&lt;/li&gt;
&lt;li&gt;traceable (show sources),&lt;/li&gt;
&lt;li&gt;easier to maintain and deploy,&lt;/li&gt;
&lt;li&gt;safer against hallucinations.&lt;/li&gt;
&lt;li&gt;That shift changed how I designed every layer.&lt;/li&gt;

  Architecture overview
&lt;/h3&gt;

&lt;p&gt;&lt;strong&gt;My pipeline:&lt;/strong&gt;&lt;/p&gt;

&lt;ol&gt;
&lt;li&gt;- Document ingestion (.pdf, .txt, .docx)&lt;/li&gt;
&lt;li&gt;- Text cleaning + smart chunking with overlap&lt;/li&gt;
&lt;li&gt;- Embedding generation (all-MiniLM-L6-v2)&lt;/li&gt;
&lt;li&gt;- Persistent vector storage in ChromaDB&lt;/li&gt;
&lt;li&gt;- Semantic retrieval (Top-K with metadata)&lt;/li&gt;
&lt;li&gt;- Strict prompt construction for grounded answers&lt;/li&gt;
&lt;li&gt;- LLM response generation via Groq (OpenAI-compatible SDK)&lt;/li&gt;
&lt;li&gt;- API response with answer + sources + confidence + latency&lt;/li&gt;
&lt;/ol&gt;

&lt;p&gt;&lt;strong&gt;What I implemented&lt;/strong&gt;&lt;/p&gt;

&lt;p&gt;1) Document processing layer&lt;br&gt;
Multi-format loaders (PDF/TXT/DOCX)&lt;br&gt;
Normalization and cleaning&lt;br&gt;
Chunking strategy with overlap for context continuity&lt;br&gt;
Metadata for each chunk (source, page, chunk_id, timestamp)&lt;/p&gt;

&lt;p&gt;2) Vector store layer&lt;br&gt;
Persistent ChromaDB collection&lt;br&gt;
Embedding + indexing pipeline&lt;br&gt;
Similarity search API&lt;br&gt;
Optional MMR-style diversity retrieval&lt;br&gt;
Collection maintenance (count, clear, delete by source)&lt;/p&gt;

&lt;p&gt;3) RAG chatbot layer&lt;br&gt;
Context builder with numbered source blocks&lt;/p&gt;

&lt;ul&gt;
&lt;li&gt;Controlled prompt rules:&lt;/li&gt;
&lt;li&gt;only answer from provided context&lt;/li&gt;
&lt;li&gt;explicitly refuse if context is insufficient&lt;/li&gt;
&lt;li&gt;always cite sources
Confidence estimation based on retrieval distance
Optional conversation history support&lt;/li&gt;
&lt;/ul&gt;

&lt;p&gt;4) FastAPI service layer&lt;br&gt;
POST /upload for ingestion + indexing&lt;br&gt;
POST /query for grounded Q&amp;amp;A&lt;br&gt;
GET /health for service checks&lt;br&gt;
GET /documents for indexed count&lt;br&gt;
POST /reload for reset operations&lt;/p&gt;

  Key production lessons
&lt;/h2&gt;

&lt;ol&gt;
&lt;li&gt;Retrieval quality &amp;gt; model size for many Q&amp;amp;A tasks.&lt;/li&gt;
&lt;li&gt;Prompt constraints matter as much as vector search.&lt;/li&gt;
&lt;li&gt;Metadata is a superpower for debugging and trust.&lt;/li&gt;
&lt;li&gt;Confidence + sources significantly improves usability.&lt;/li&gt;
&lt;li&gt;Observability (latency/logging/errors) is not optional.&lt;/li&gt;
&lt;/ol&gt;

  Final thought
&lt;/h2&gt;

&lt;p&gt;Building RAG is easy.&lt;br&gt;
Building reliable RAG is where the real engineering starts.&lt;/p&gt;
